Universal Piecewise Polynomial Estimators for Machine Learning

چکیده
We review and expand somewhat on some recent developments concerning the construction and analysis of piecewise polynomial estimators for the regression problem in Mathematical Learning Theory. The discussion will center on two issues. The first of these is computational efficiency including possible online capability. The second is universality by which we mean the capability of the estimator to give rise to optimal convergence rates for a possibly wide class of prior classes without using any a-priori knowledge on the memebership of the regression function to any of these classes. More precisely, the main point of interest are estimators for which the probability of exceeding an optimal rate tends to zero as the number m of observed data increases. We focus on nonlinear methods built on piecewise polynomial approximation on adaptively refined partitions. We describe a class of schemes that are inspired by thresholding concepts for wavelet expansions. We point out obstacles to treating piecewise polynomials of degree higher than one as compared with piecewise constant estimators and discuss several possible remedies.

A Convex Parametrization of a New Class of Universal Kernel Functions for use in Kernel Learning
We propose a new class of universal kernel functions which admit a linear parametrization using positive semidefinite matrices. These kernels are generalizations of the Sobolev kernel and are defined by piecewise-polynomial functions. The class of kernels is termed “tessellated” as the resulting discriminant is defined piecewise with hyper-rectangular domains whose corners are determined by the...
متن کاملFault Detection of Anti-friction Bearing using Ensemble Machine Learning Methods
Anti-Friction Bearing (AFB) is a very important machine component and its unscheduled failure leads to cause of malfunction in wide range of rotating machinery which results in unexpected downtime and economic loss. In this paper, ensemble machine learning techniques are demonstrated for the detection of different AFB faults. Initially, statistical features were extracted from temporal vibratio...
متن کاملNonparametric learning and Regularization
Several nonparametric methods in a regression model are presented. First, the most classical ones: piecewise polynomial estimators, estimation with Spline bases, kernel estimators and projection estimators on orthonormal bases (such as Fourier or wavelet bases). Since these methods suffer from the curse of dimensionality, we also present Generalized Additive Models and CART regression models. T...
متن کاملInducing Polynomial Equations for Regression
Regression methods aim at inducing models of numeric data. While most state-of-the-art machine learning methods for regression focus on inducing piecewise regression models (regression and model trees), we investigate the predictive performance of regression models based on polynomial equations. We present Ciper, an efficient method for inducing polynomial equations and empirically evaluate its...
متن کاملUniversal Algorithms for Learning Theory Part I : Piecewise Constant Functions
This paper is concerned with the construction and analysis of a universal estimator for the regression problem in supervised learning. Universal means that the estimator does not depend on any a priori assumptions about the regression function to be estimated. The universal estimator studied in this paper consists of a least-square fitting procedure using piecewise constant functions on a parti...
